Undervoltage warning despite decent power supply

I found some related questions about this, yet no answer. Using a freshly bought "5V/2.1A" rated power supply, I get undervoltage warning icon on both my Raspberry Pi 3s. I measure 4.75V at the USB ports. I feel like this should not be happening.
